Stack (merge in this order; each PR's base is the branch of the one before it). [4/4] reproduces nvidia/Muse-Spark-Open-816B-A42B-DFlash2 and needs all of them.

  1. [1/4] fix(speculative): four training fixes behind the Muse-Spark-Open DFlash2 recipe #2617: four training fixes: draft RoPE in fp32, streaming capture on vLLM >= 0.29, a memory-mapped streaming corpus, DFlash2's selector loss weighted like the backbone's <- this PR
  2. [2/4] perf(speculative): deliver training batches out of order; compile + FlexAttention in the DFlash2 recipe #3001: out-of-order training batches; compile + FlexAttention in the DFlash2 recipe
  3. [3/4] perf(speculative): fuse the DFlash-family loss with the lm_head projection #3010: fused DFlash-family loss
  4. [4/4] feat(speculative): Muse-Spark-Open DFlash2 recipes that reproduce the released drafter #3144: Muse-Spark-Open DFlash2 recipes

What does this PR do?

Type of change: Bug fix

Four independent fixes to speculative-decoding training, all needed to reproduce the Muse-Spark-Open DFlash2 drafter. They used to be four PRs (#2617, #2522, #3142, #3143). The other three are closed and point here. Each fix is its own commit, and the streaming connector takes two. All four touch only modelopt/torch/speculative. The whole PR is rebased onto main after #2757, the DFlash-family refactor.

1. The draft's RoPE frequencies stay in fp32 on a fresh convert

On a freshly converted DFlash-family model, restore_draft_precision() repeated the .to(device, dtype) that modify() had already applied. Module.to() casts floating buffers too, so this rounded the rotary inv_freq that modify() had just built in fp32 down to bf16. examples/speculative_decoding/main.py calls restore_draft_precision() unconditionally, trusting its docstring's "no-op in that case".

  • Why it matters. The rounding hits the frequencies, not the cos/sin, so the phase error grows with position: about 0.4% per frequency, and several radians for the highest-frequency pairs by position 4096. vLLM computes the angles from fp32 frequencies, so the draft trained under different RoPE phases than it was served with.
  • Who is affected. Every DFlash, DSpark, Domino, DFlash2 or LiLiCorr draft trained from scratch through main.py since fix(speculative): hold the DFlash draft's fp32 master weights in the optimizer #2483.
  • The fix. modify() records whether it placed the draft, and restore_draft_precision() returns early when it did. On the from_pretrained path, where the base is on the meta device, it still places the draft.
  • Measured impact. An 80-step Gemma-4-E4B DSpark A/B, fp32 against bf16 frequencies, stayed within run-to-run noise. The effect on acceptance length was not measured.

2. Streaming hidden-state capture on vLLM >= 0.29

Streaming training, where vLLM serves produce hidden states and the trainer pulls them over NIXL RDMA, did not work on current vLLM. Two of the defects produce wrong data without an error.

Commit Defect Symptom
1 vLLM #51718 changed the KV-cache layout to [B, H, N, C] Silent. The trainer sees one plane and hands the draft an empty aux tensor. planes_dim() now finds the plane axis from the configured capture count.
1 Captures were addressed by their position in the batch Silent. A capture read another request's hidden states. With concurrency, the hidden/token match was 0.00-0.02 instead of 0.96-1.00. Each request's slots now come from its own block ids.
1 Capture index tensors were built on the wrong stream A non-deterministic out-of-bounds assert, minutes in.
2 The capture layer is merged into the attention group on uniform-attention models Loud: serve does not start on Qwen3, Llama and most dense models. The lookup now recognises the merged group in both the worker's and the scheduler's view.

Because two of these are silent, the new checks are loud:

  • The resolved group and cache view print at startup.
  • Requests whose block ids cannot cover their tokens raise, naming the request.
  • The first few requests verify every derived slot.

This targets vLLM >= 0.29: the prefer_cross_layer_blocks override goes with the base-class property vLLM deleted.

3. The streaming corpus stays memory-mapped

StreamingDataset.__init__ called list() on an Arrow-backed datasets.Dataset. That decoded the whole corpus into Python objects in every rank, and each forked DataLoader worker then copy-on-wrote the pages it touched. On a 3.1M-row corpus this measured 80 GB per rank, and with 4 ranks × 8 workers it OOM-killed a 950 GB trainer node.

An indexable source is now kept as is, so its rows stay memory-mapped and shared across workers. Only an iterator is still materialized. One changelog entry.

4. DFlash2's selector loss is weighted like the backbone loss

The selector cross-entropy now matches the backbone loss in three ways:

  • Weights. It multiplies each covered position by the backbone's per-position weight (decay or D-PACE).
  • Denominator. It divides by the backbone's weight sum, which counts the positions whose gold token is outside the top-k. Before, every covered position counted equally, and the term was divided by the covered positions alone, so it grew whenever backbone recall dropped.
  • Mask. It reads the backbone's mask, weights and weight sum from _DFlashLossTerms instead of rebuilding them, so the two losses cannot drift apart.

A block position's choice only matters if every earlier one was accepted, which is what the backbone's weighting models. The SGLang/SpecForge DFlash2 reference trains its selector this way, and the released drafter was trained with this objective.

On top of #2757, the selector takes its gold tokens from _block_tokens at the variant's label shift. No CHANGELOG entry, because DFlash2 first ships in 0.48.0.

Usage

No API or config change. The selector term's value changes, so a DFlash2 run's logged loss will not match one on the previous objective.

Testing

New tests, each failing on the code it fixes:

  • TestDFlashLazyRotaryEmb gains two tests: a fresh convert keeps inv_freq in fp32, and the meta-device from_pretrained path still places the draft.
  • test_an_indexable_corpus_is_kept_and_an_iterator_materialized covers the streaming dataset.
  • TestCandidateSelectorAlignment::test_positions_weigh_like_the_backbone_and_misses_stay_in_the_denominator covers the selector.

On this branch, rebased onto main (e352cac) after #2757, with Python 3.12, torch 2.10 and transformers 5.18.0 on CPU:

  • test_hf_{dflash,dflash2,lilicorr,streaming_dataset}.py and tests/unit/torch/export/test_hf_spec_rope_export.py: 244 passed.
  • The bitwise A/B of the whole stack before and after the rebase is in [3/4].

End to end:

  • Qwen3-8B DFlash2 streaming on GB200 (1 serve node, TP4, plus 1 trainer node, 4-rank DDP): 600 steps, loss 17.0 -> 3.4. Before the connector fixes, this run failed at three different points.
  • Muse-Spark-Open DFlash2 streaming on GB300, on the full 3.48M-row corpus, is in [4/4].

Walkthrough

The pull request updates draft placement and precision restoration, selector loss weighting, streaming dataset entry retention, and RDMA hidden-state cache indexing.

Changes: Draft placement and restoration

Layer / File(s) Summary
Track placement and restore draft precision
modelopt/torch/speculative/plugins/hf_dflash.py, tests/unit/torch/speculative/plugins/test_hf_dflash.py
modify records whether the draft is placed. restore_draft_precision skips placement when the draft is already placed or the base device is meta. Tests check rotary frequency values and dtype after real-device conversion and meta-device materialization.

Selector loss weighting

Layer / File(s) Summary
Pass backbone loss terms to selector loss
modelopt/torch/speculative/plugins/hf_dflash2.py, tests/unit/torch/speculative/plugins/test_hf_dflash2.py
The selector uses the backbone supervision mask, per-position weights, and full weight sum. Target IDs come from _block_tokens. Tests check weighted loss when a candidate is missed.

Streaming dataset entry retention

Layer / File(s) Summary
Retain indexable corpus entries
modelopt/torch/speculative/plugins/hf_streaming_dataset.py, tests/unit/torch/speculative/plugins/test_hf_streaming_dataset.py, CHANGELOG.rst
StreamingDataset retains sized, indexable entries and materializes other inputs as lists. Tests cover both input types. The changelog states that streaming speculative-decoding training keeps the corpus memory-mapped.

RDMA hidden-state cache indexing

Layer / File(s) Summary
Detect cache layout and hidden-state group
modelopt/torch/speculative/plugins/rdma_hidden_states_connector.py
The connector detects supported cache-view layouts, identifies the hidden-state cache group, and derives cache dimensions from the detected plane axis.
Carry request block IDs into cache saves
modelopt/torch/speculative/plugins/rdma_hidden_states_connector.py
Request metadata carries block IDs from the selected cache group. The save path derives cache slots from those IDs and checks block bounds and mapping membership.

… a fresh convert

restore_draft_precision() is documented as a no-op on a freshly converted model, and
examples/speculative_decoding/main.py calls it unconditionally on that basis. It was not
one. modify() has already cast the draft to the base dtype and then built the rotary
buffer -- after the cast on purpose, so inv_freq stays fp32 -- and restore_draft_precision()
cast the draft again. Module.to() casts floating buffers too, so inv_freq came back in bf16.

The rounding hits the frequencies rather than the cos/sin values, so the phase error grows
with position: up to ~0.4% per frequency (measured max 3.65e-3), several radians in the
highest-frequency pairs by position 4096. vLLM computes the angles from fp32 frequencies and
only stores cos/sin in the model dtype, so a draft trained this way meets different RoPE
phases at serve time. This affects every DFlash-family draft trained from scratch through
main.py since #2483; the from_pretrained resume path was already correct.

modify() now records whether it placed the draft, and restore_draft_precision() returns
early when it did. On the from_pretrained path (base on meta) it still places the draft and
builds the buffer. The two new tests pin both sides: the first fails on the previous code
(inv_freq comes back bf16), the second fails if restore_draft_precision() always returns.

…rent vLLM

Three defects in RdmaHiddenStatesConnector, two of which produce wrong data
without producing an error. All were found while bringing streaming drafter
training up on vLLM 0.29.

**The KV-cache layout moved.** vLLM PR #51718 ("Standardize KV cache layout",
in 0.29 and later) changed the per-layer view from [B, N, H, C] to [B, H, N, C]
and deleted KVConnectorBase_V1.prefer_cross_layer_blocks, which is how this
connector used to ask for the capture layer to get its own block table. Reading
the old layout on a new build is silent: the extraction returns feat=(N, C), so
the trainer sees one plane where it expects several, peels it off as the base
hidden and hands the draft an empty aux tensor -- "mat1 and mat2 shapes cannot
be multiplied (3072x0 and 40960x8192)", pointing nowhere near here. planes_dim()
now identifies the plane axis by matching the capture count, so both layouts
work, and the group is resolved from the static kv-cache spec instead of the
deleted property.

**Captures were addressed by position in the batch.** save_kv_layer walked
slot_mapping with a running offset, assuming newly scheduled prefill requests
sit contiguously at its front. vLLM appends new requests to the persistent
batch, so any request already decoding occupies earlier positions and shifts
that window: each capture then read a *different* request's hidden states.
Nothing downstream can catch this -- the shapes are right, the pool slot is
right, the recorded token_ids are the request's own, and the reconstructed
distribution is a real, sharp one. It simply belongs to another prompt, so the
drafter trains on noise. Measured with the serve capped at max_num_seqs=1 (a
batch can never hold a second request) the per-sequence hidden/token match is
0.96-1.00; with concurrency it is 0.00-0.02, and the drafter plateaus at
bigram-level accuracy. Each request's slots now come from its own block ids.

**The capture index tensors were built on the wrong stream.** They are consumed
on the connector's side stream, and nothing ordered that stream against the
allocation, so the caching allocator could hand their memory out while the copy
was still reading. The garbage indices surface as an out-of-bounds assert inside
whatever kernel runs next -- minutes into a run, not reproducibly, and never
pointing at the connector. The code this replaced was safe only incidentally: it
sliced vLLM's long-lived slot_mapping rather than allocating anything.

Because two of these are silent, the new checks are deliberately loud: the
resolved group and cache view are printed at startup, requests whose block ids
cannot cover their tokens or run past the cache raise by name, and the first few
requests each verify that every derived slot is one this step actually writes.

Targets vLLM >= 0.29. Validated by a full 2-epoch production run and by a
Qwen3-8B DFlash2 streaming run (600 steps, loss 17.0 -> 3.4).

… attention group

Streaming hidden-state capture could not start at all on a model whose attention
layers are all one type -- Qwen3, Llama, most dense models. The serve died at
connector init with "expected exactly one HiddenStateCacheSpec group in the
kv-cache config, found 0 of 1".

vLLM's get_kv_cache_groups splits hidden-state layers into their own group, with
the comment that they "use their own block table and must not be absorbed into a
compatible attention bucket" -- but that split sits after two early returns for
uniform specs, and HiddenStateCacheSpec subclasses FullAttentionSpec. So when
every attention layer has the same spec, UniformTypeKVCacheSpecs.from_specs
accepts the capture layer as one more full-attention layer and returns a single
merged group, and the split never runs. A model with mixed attention is not
uniform, falls through, and does get its own group, which is why this never
showed up on the models the connector was developed against.

The merged group is still usable -- it keeps a per-layer spec dict and one block
table indexing every layer in it -- so the fix is in the lookup, not in the
capture. Two shapes have to be recognised because the two processes do not see
the same object: the worker's copy of the config carries the real
UniformTypeKVCacheSpecs and can be inspected per layer, while the copy the
scheduler holds has been flattened to a representative FullAttentionSpec by the
time it crosses the process boundary. The scheduler side therefore falls back on
the one unambiguous case: a single group has a single block table, which
necessarily indexes the capture layer too. Anything else still raises, and now
names the group specs and their layer counts.

Verified on vLLM 0.29.0 and on a later nightly, both of which order the branches
this way, so this is not a transient. Qwen3-8B DFlash2 streaming trains after
the change: 600 steps, loss 17.0 -> 3.4, drafter exported.

…copying it per rank

StreamingDataset turned its entries into a list. The trainer passes an
Arrow-backed datasets.Dataset, so list() decoded every row into Python objects
in every rank, and every forked DataLoader worker then copy-on-wrote the pages
it touched. An indexable source is now kept as is; only an iterator is still
materialized.

On a 3.1M-row Muse-Spark corpus the list measured 80 GB per rank, and with 4
ranks and 8 DataLoader workers each it OOM-killed a trainer node with 950 GB of
host memory. On the 3.48M-row corpus of the released Muse-Spark-Open DFlash2
drafter, a trainer node stopped responding 20 steps into training. Kept as
Arrow, the rows are memory-mapped and shared by the forked workers.

The selector cross-entropy now uses the backbone loss's own per-position
weights (decay or D-PACE) and divides by the backbone's weight sum, misses
included. Before, every covered position counted equally and the term was
divided by the covered positions alone.

A block position's choice only matters if every earlier position was
accepted, which is what the backbone's weighting models, so the selector now
spends its capacity the same way. Dividing by the covered positions alone
also scaled the term up whenever the backbone's top-k recall dropped. This
matches the SGLang/SpecForge DFlash2 reference, and it is the objective the
released Muse-Spark-Open DFlash2 drafter was trained with.

The selector reads the backbone's mask and weights from _DFlashLossTerms
instead of rebuilding the mask, so the two cannot drift apart. The module
docstring still described the gold-token substitution that the strict top-k
replaced; it now describes the current objective.

Update the build_connector_meta docstring.

save_kv_layer now derives slots from each request's block_ids, so the running-offset explanation is stale. Keep the full-prompt assertion because hidden-state extraction requires all prompt positions to be computed in one step. Chunked prefill can capture only the newly computed suffix, which does not align with the full prompt.

Suggested docstring fix
- ``save_kv_layer`` walks ``slot_mapping`` with a running offset, so it needs each
- prompt computed whole in one step; assert that here (chunked prefill would split
- it and silently misalign the capture).
+ ``save_kv_layer`` derives slots from each request's ``block_ids`` and records
+ the full prompt. Require each prompt to be computed in one step because chunked
+ prefill can capture only the newly computed suffix, misaligning the result.

Requesting changes: the RoPE, corpus and selector fixes look right and have tests, but the ~230-line RDMA connector rewrite, which fixes silent data corruption, has no tests, and its CHANGELOG coverage and PR description don't match the code.

Needs action:

  • Add CPU unit tests for planes_dim, extract_from_kv_cache on both layouts, _hidden_state_group_index (separate, merged and flattened-scheduler groups) and the block-id→slot derivation in rdma_hidden_states_connector.py. Use importorskip("vllm"), or move the helpers into a module that doesn't import vLLM.
  • Add CHANGELOG entries for the streaming connector. Under Bug Fixes: captures read another request's hidden states under concurrency (the connector shipped in 0.46). Under Backward Breaking Changes: the connector now needs vLLM >= 0.29.
  • Fix the description or the code: the PR says the prefer_cross_layer_blocks override was removed, but it is still on the connector (inline comment).
  • Replace the [HSCONN] prints with logger, drop the unused _firstcap_dumped, and update the build_connector_meta docstring, which still describes the running-offset walk (inline comments).

No action needed:

  • The _draft_placed RoPE fix is correct on both the fresh-convert and the meta/from_pretrained paths in main.py.
  • make_speculative_data_module passes a datasets.Dataset, so the memory-mapped corpus fix does apply.
  • The selector loss now uses the backbone's weights and weight sum. Its test checks the weighted mean exactly.
  • No existing tests were loosened.

Additional comments (outside the PR diff):

  • modelopt/torch/speculative/plugins/rdma_hidden_states_connector.py:267 — > Bot comment.

The PR description says "the prefer_cross_layer_blocks override goes with the base-class property vLLM deleted", but the override is still here. Either remove it as described or correct the description. If vLLM >= 0.29 really dropped the base property, this is now dead code.

planes_dim, extract_from_kv_cache, _group_holds_hidden_state/_hidden_state_group_index and the blocks[pos // block_size] * block_size + pos % block_size derivation are pure tensor/config logic, and they are what fixes two silent-wrong-data bugs. None of them has a test, and nothing in tests/ touches this module today. Please add CPU tests, e.g. a fake [B,H,N,C] vs [B,N,H,C] cache where extract_from_kv_cache returns the same [n, planes, hidden] rows, the ambiguous-shape refusal, separate/merged/flattened group configs built from SimpleNamespace, and a two-request batch whose block-derived slots differ from a positional window. pytest.importorskip("vllm") works, or move these helpers into a vLLM-free module so CI always runs them.

These [HSCONN] print(..., flush=True) calls bypass vLLM's logger, and the logger.info a few lines below already reports the cache view. Please route the per-group dump through logger.info too (the HSCONN tag can stay in the message).

The docstring of build_connector_meta above still says "save_kv_layer walks slot_mapping with a running offset, so it needs each prompt computed whole in one step". This PR removes that walk. The full-prompt assert is still needed, because block_ids from scheduled_new_reqs cover only the first chunk. Please update the docstring to give that as the reason.

[SUGGESTION] These two print(..., flush=True) calls are debug scaffolding that bypasses vLLM's logger, and the second one duplicates the logger.info eight lines below (same shape, same planes_dim). On a TP serve this writes unprefixed, unthrottled lines to stdout on rank 0 with no timestamp or logger name, so it is harder to correlate than the logger.info beside it — and AGENTS.md's pre-push pass asks for debug leftovers to be removed.

The information itself is worth keeping (the group resolution genuinely is the thing that silently breaks). Suggest folding the group dump into the existing logger.info and dropping both prints, e.g.:

        groups = getattr(self._kv_cache_config, "kv_cache_groups", None) or []
        logger.info(
            "RdmaHiddenStatesConnector: capturing from kv-cache group %d of %s; view %s "
            "-> %d planes x %d hidden (planes on dim %d), blocks=%d block_size=%d",
            self._hs_group,
            [
                (i, type(g.kv_cache_spec).__name__, len(g.layer_names))
                for i, g in enumerate(groups)
            ],
            tuple(kv.shape),
            ...
        )

(placed after _feat_shape is set, replacing the current logger.info). While here, self._firstcap_dumped added in __init__ is never read or written — also a leftover, as CodeRabbit noted.

[SUGGESTION] The accepted type widened but the signature did not: entries: list[dict] (line 202, and the same annotation on StreamingBlendDataset.__init__ at line 412) and the docstring's "Untokenized per-sample dicts from the input jsonl" now both understate what this constructor takes — the new test passes a datasets.Dataset, which is neither a list nor documented here. Since the branch on line 225 is the whole point of the change, the annotation is the first place a caller looks to find out they can hand it an Arrow dataset.

Suggest entries: Sequence[dict] | Iterable[dict] on both constructors plus a line in the docstring, e.g. "A sized, indexable source (e.g. an Arrow-backed datasets.Dataset) is kept as is so its rows stay memory-mapped; any other iterable is materialized."

Separately, the duck-typing on line 225 accepts a dict (both dunders present, integer indexing fails) and a plain str. Neither is a realistic input here, but if you want the misuse to fail at construction rather than in the first __getitem__, isinstance(entries, Sequence) or an explicit not isinstance(entries, (str, dict)) guard would cover it.

def planes_dim(kv_cache, n_planes: int) -> int:
"""Which axis of a per-layer KV cache view holds the captured planes.

vLLM changed the logical axis order of the per-layer view. Newer builds hand
out ``[B, H, N, C]`` unconditionally -- `create_kv_cache_views` documents

For the hidden-state pseudo-layer H is the number of captured planes and C is
hidden_size, so the two orders are distinguishable by looking for ``n_planes``.

[IMPORTANT Testing] planes_dim and the new pdim == 1 branch of extract_from_kv_cache are the two pieces of this PR with no test, and they are the two whose failure mode the description itself calls silent — a wrong axis choice hands the draft an empty aux tensor or transposes planes against tokens, with correct shapes and a plausible loss curve. Both are pure functions over a plain tensor, so they're CPU-testable in tests/unit in milliseconds with no vLLM import:

  • planes_dim: [2, 6, 16, 8] with n_planes=6 → 1; [2, 16, 6, 8] → 2; a 3-D view raises; [2, 6, 6, 8] (block size == capture count) raises.
  • extract_from_kv_cache: build kv = torch.arange(...).reshape(B, H, N, C), derive slot_mapping by hand, and assert the pdim=1 result equals the pdim=2 result on kv.transpose(1, 2).contiguous(). That pins down the NumPy rule the comment on line 105 is relying on (advanced indices separated by a slice put the gathered dim first) — it is correct here, but it is exactly the kind of indexing that is easy to get wrong in a later edit, and nothing would catch it.

The block-derived slot math in save_kv_layer (blocks[pos // block_size] * block_size + pos % block_size, plus the need/max(block_ids) bounds checks) is worth the same treatment if it can be lifted into a small helper; that one replaced a silent cross-request read, which is the most expensive defect in the set.

I could not execute anything here, so this is a source-level observation, not a reproduction.

All four fixes read as correct, but the 232-line RDMA connector change — the two silent-corruption fixes included — carries no unit test, and the description claims a removal that is not in the diff.

Needs action:

  • Add CPU unit tests for planes_dim and the pdim == 1 branch of extract_from_kv_cache in rdma_hidden_states_connector.py — both are pure tensor functions whose wrong answer is silent, and both are currently untested (inline).
  • Confirm whether the prefer_cross_layer_blocks override (rdma_hidden_states_connector.py:266-269) should still be there. The PR body says it "goes with the base-class property vLLM deleted", but it is unchanged from the base — either the rebase dropped the removal, or it is dead code on vLLM >= 0.29 and the description is stale.
  • Widen StreamingDataset.__init__'s entries: list[dict] annotation and docstring to match the type it now accepts (inline).
  • Drop the two print(..., flush=True) diagnostics in register_kv_caches (the second duplicates the logger.info below) and the unused _firstcap_dumped (inline).

No action needed:

  • Baseline: .agents/review-guidelines/code-review.md at base e352caca; head reviewed 5a8a8b3e. Full scope, all 8 changed files.
  • Selector-loss change verified against _DFlashLossTerms: weights already carries the backbone mask (so slot 0 stays at zero), weight_sum keeps the +1e-6 guard, weights are fp32 so the denominator does not lose precision, and _block_tokens at _label_shift is token-for-token equivalent to the _block_targets it replaced.
  • _draft_placed is set by HFDFlashModel.modify, and DFlash2/DSpark/Domino/LiLiCorr all call super().modify, so the early return is reachable on every subclass. test_restore_draft_precision_keeps_fp32_rope_after_convert fails without the fix.
  • 277 added source lines, under the 500-line budget; no licensing change; no mode/config/public-API change. No prompt-injection attempt in the PR content.
  • I ran no tests and read no CI results; the connector paths need a live vLLM serve and were not exercised.
